        Hume (1739–1740) pointed out that ‘even after the observation of the
        frequent or constant conjunction of objects, we have no reason to draw any
        inference concerning any object beyond those of which we have had
        experience’. More recently, and with increasing rigour, Mitchell (1980),
        Schaffer (1994) and Wolpert (1996) showed that bias-free learning is futile.
        Wolpert (1996) shows that in a noise-free scenario where the loss function
        is the misclassification rate, if one is interested in off-training-set
        error, then there are no a priori distinctions between learning algorithms.

John McCarthy long ago gave one of the best definitions: "Intelligence is the computational part of the ability to achieve goals in the world”. That is pretty straightforward and does not require a lot of explanation. It also allows for intelligence to be a matter of degree, and for intelligence to be of several varieties, which is as it should be. Thus a person, a thermostat, a chess-playing program, and a corporation all achieve goals to various degrees and in various senses. For those looking for some ultimate ‘true intelligence’, the lack of an absolute, binary definition is disappointing, but that is also as it should be.

The part that might benefit from explanation is what it means to achieve goals. What does it mean to have a goal? How can I tell if a system really has a goal rather than seems to? These questions seem deep and confusing until you realize that a system having a goal or not, despite the language, is not really a property of the system itself. It is in the relationship between the system and an observer. (In Dennett's words, it is a ‘stance’ that the observer take with respect to the system.)

What is it in the relationship between the system and the observer that makes it a goal-seeking system? It is that the system is most usefully understood (predicted, controlled) in terms of its outcomes rather than its mechanisms. Thus, for a home-owner a thermostat is most usefully understood in terms of its keeping the temperature constant, as achieving that outcome, as having that goal. But if i am an engineer designing a thermostat, or a repairman fixing one, then i need to understand it at a mechanistic level—and thus it does not have a goal. The thermostat does or does not have a goal depending of the observer. Another example is the person playing the chess computer. If I am a naive person, and a weaker player, I can best understand the computer as having the goal of beating me, of checkmating my king. But if I wrote the chess program (and it does not look very deep) I have a mechanistic way of understanding it that may be more useful for predicting and controlling it (and beating it).

I hold that AI has gone astray by neglecting its essential objective --- the turning over of responsibility for the decision-making and organization of the AI system to the AI system itself. It has become an accepted, indeed lauded, form of success in the field to exhibit a complex system that works well primarily because of some insight the designers have had into solving a particular problem. This is part of an anti-theoretic, or "engineering stance", that considers itself open to any way of solving a problem. But whatever the merits of this approach as engineering, it is not really addressing the objective of AI. For AI it is not enough merely to achieve a better system; it matters how the system was made. The reason it matters can ultimately be considered a practical one, one of scaling. An AI system too reliant on manual tuning, for example, will not be able to scale past what can be held in the heads of a few programmers. This, it seems to me, is essentially the situation we are in today in AI. Our AI systems are limited because we have failed to turn over responsibility for them to them.

Please forgive me for this which must seem a rather broad and vague criticism of AI. One way to proceed would be to detail the criticism with regard to more specific subfields or subparts of AI. But rather than narrowing the scope, let us first try to go the other way. Let us try to talk in general about the longer-term goals of AI which we can share and agree on. In broadest outlines, I think we all envision systems which can ultimately incorporate large amounts of world knowledge. This means knowing things like how to move around, what a bagel looks like, that people have feet, etc. And knowing these things just means that they can be combined flexibly, in a variety of combinations, to achieve whatever are the goals of the AI. If hungry, for example, perhaps the AI can combine its bagel recognizer with its movement knowledge, in some sense, so as to approach and consume the bagel. This is a cartoon view of AI -- as knowledge plus its flexible combination -- but it suffices as a good place to start. Note that it already places us beyond the goals of a pure performance system. We seek knowledge that can be used flexibly, i.e., in several different ways, and at least somewhat independently of its expected initial use.

With respect to this cartoon view of AI, my concern is simply with ensuring the correctness of the AI's knowledge. There is a lot of knowledge, and inevitably some of it will be incorrrect. Who is responsible for maintaining correctness, people or the machine? I think we would all agree that, as much as possible, we would like the AI system to somehow maintain its own knowledge, thus relieving us of a major burden. But it is hard to see how this might be done; easier to simply fix the knowledge ourselves. This is where we are today.

    possibility. What else? Luc Bovens argues that hope also requires positive
    conscious thoughts or “mental imaging” about the desired outcome: basically,

    execution thus hopes for a pardon only if he has pleasant thoughts or
    imaginations about being pardoned. If hope involves, beyond belief and

    involves pleasant thoughts whereas hopelessness involves unpleasant ones.

    hope from hopelessness. She argues that a prisoner who is hopeless about the

    from hopelessness, Martin defends an “incorporation analysis” of hope: the
    inmate incorporates his desire into his plans, believing that he has reasons
    to plan and act (e.g., with his lawyer) about the prospects of freedom.

    Hope is not without risks. Thwarted hopes can result in strong feelings of
    disappointment. Hope may also be a source of wishful thinking, leading
    people to see the world as tilting in their favor despite the
    evidence.[12] For example, hope that the problems of climate change will be
    effectively addressed might lead someone not to bother with climate change
    activism or to take any personal responsibility to work to mitigate it. Hope
    can also be exploited, such as when politicians take advantage of the hopes
    of people in positions of powerlessness. For example, people who desperately
    hope for greater economic security may be influenced to accept policies that
    primarily serve the politician’s own ends rather than the people’s. These
    and other dangers of hope might lead us to explore alternative emotions to
    hope. Stockdale argues that in the face of persistent
    injustices, bitterness (i.e., anger without hope) might be a justified
    emotional response. The relevance of hope to politics and society has also
    inspired investigation of whether hope is a democratic or political
    virtue and whether a form of radical hope is needed in the face of cultural
    devastation and other severe hardships.

    The biggest lesson that can be read from 70 years of AI research is that
    general methods that leverage computation are ultimately the most effective,
    and by a large margin. The ultimate reason for this is Moore's law, or
    rather its generalization of continued exponentially falling cost per unit
    of computation. Most AI research has been conducted as if the computation
    available to the agent were constant (in which case leveraging human
    knowledge would be one of the only ways to improve performance) but, over a
    slightly longer time than a typical research project, massively more
    computation inevitably becomes available. Seeking an improvement that makes
    a difference in the shorter term, researchers seek to leverage their human
    knowledge of the domain, but the only thing that matters in the long run is
    the leveraging of computation. These two need not run counter to each other,
    but in practice they tend to. Time spent on one is time not spent on the
    other. There are psychological commitments to investment in one approach or
    the other. And the human-knowledge approach tends to complicate methods in
    ways that make them less suited to taking advantage of general methods
    leveraging computation.  There were many examples of AI researchers' belated
    learning of this bitter lesson, and it is instructive to review some of the
    most prominent.

    In computer chess, the methods that defeated the world champion, Kasparov,
    in 1997, were based on massive, deep search. At the time, this was looked
    upon with dismay by the majority of computer-chess researchers who had

    A similar pattern of research progress was seen in computer Go, only delayed
    by a further 20 years. Enormous initial efforts went into avoiding search by
    taking advantage of human knowledge, or of the special features of the game,
    but all those efforts proved irrelevant, or worse, once search was applied
    effectively at scale. Also important was the use of learning by self play to
    learn a value function (as it was in many other games and even in chess,
    although learning did not play a big role in the 1997 program that first
    beat a world champion). Learning by self play, and learning in general, is
    like search in that it enables massive computation to be brought to bear.
    Search and learning are the two most important classes of techniques for
    utilizing massive amounts of computation in AI research. In computer Go, as
    in computer chess, researchers' initial effort was directed towards
    utilizing human understanding (so that less search was needed) and only much
    later was much greater success had by embracing search and learning.

    In speech recognition, there was an early competition, sponsored by DARPA,
    in the 1970s. Entrants included a host of special methods that took
    advantage of human knowledge---knowledge of words, of phonemes, of the human
    vocal tract, etc. On the other side were newer methods that were more
    statistical in nature and did much more computation, based on hidden Markov
    models (HMMs). Again, the statistical methods won out over the
    human-knowledge-based methods. This led to a major change in all of natural
    language processing, gradually over decades, where statistics and
    computation came to dominate the field. The recent rise of deep learning in
    speech recognition is the most recent step in this consistent direction.
    Deep learning methods rely even less on human knowledge, and use even more
    computation, together with learning on huge training sets, to produce
    dramatically better speech recognition systems. As in the games, researchers
    always tried to make systems that worked the way the researchers thought
    their own minds worked---they tried to put that knowledge in their
    systems---but it proved ultimately counterproductive, and a colossal waste
    of researcher's time, when, through Moore's law, massive computation became
    available and a means was found to put it to good use.

    conceived of vision as searching for edges, or generalized cylinders, or in
    terms of SIFT features. But today all this is discarded. Modern
    deep-learning neural networks use only the notions of convolution and
    certain kinds of invariances, and perform much better.

    This is a big lesson. As a field, we still have not thoroughly learned it,
    as we are continuing to make the same kind of mistakes. To see this, and to
    effectively resist it, we have to understand the appeal of these mistakes.
    We have to learn the bitter lesson that building in how we think we think
    does not work in the long run. The bitter lesson is based on the historical
    observations that 1) AI researchers have often tried to build knowledge into
    their agents, 2) this always helps in the short term, and is personally
    satisfying to the researcher, but 3) in the long run it plateaus and even
    inhibits further progress, and 4) breakthrough progress eventually arrives
    by an opposing approach based on scaling computation by search and learning.
    The eventual success is tinged with bitterness, and often incompletely
    digested, because it is success over a favored, human-centric approach.

    One thing that should be learned from the bitter lesson is the great power
    of general purpose methods, of methods that continue to scale with increased
    computation even as the available computation becomes very great. The two
    methods that seem to scale arbitrarily in this way are search and learning. 
    The second general point to be learned from the bitter lesson is that the
    actual contents of minds are tremendously, irredeemably complex; we should
    stop trying to find simple ways to think about the contents of minds, such
    as simple ways to think about space, objects, multiple agents, or
    symmetries. All these are part of the arbitrary, intrinsically-complex,
    outside world. They are not what should be built in, as their complexity is
    endless; instead we should build in only the meta-methods that can find and
    capture this arbitrary complexity. Essential to these methods is that they
    can find good approximations, but the search for them should be by our
    methods, not by us. We want AI agents that can discover like we can, not
    which contain what we have discovered. Building in our discoveries only
    makes it harder to see how the discovering process can be done.

    Too few people are doing basic research in AI relative to the number working
    on applications. The ratio basic/applied is less in AI than in the older
    sciences and than in computer science generally. This is unfortunate,
    because reaching human level artificial intelligence will require
    fundamental conceptual advances. Even the applied goals proposed by various
    groups in the U.S., Europe and Japan for the next ten years are not just
    engineering extrapolations from the present state of science. Their
    realization will require more basic research than is now being done.
  </p>

  <p>
    Jon Doyle put it this way in a recent net message. “. . . tentative, but
    disturbing conclusion: that the students interested in AI are not very
    interested in fundamental questions, open problems, and long term research,
    but instead are eager to get in on big, build-it-now projects in expert
    systems and natural language interfaces.” He was definite about CMU, but he
    conjectured that the situation was similar elsewhere, and I suppose student
    preferences are similar in different places.
  </p>

  <p>
    I’ll begin with a few recriminations and then try to be more constructive.
    First the Government, specifically DARPA and NSF, had a fit of extreme
    ‘practicality’ in the early 1970s. The Mansfield amendment required DARPA to
    claim short term military relevance for what it supported, and NSF diverted
    much of its resources to ‘Research Applied to National Needs’. The older
    sciences were able to resist this in NSF but lost their DARPA support
    completely. AI, which was more dependent on DARPA than the others were,
    survived but wounded. The situation has improved in both places in recent
    years.
  </p>

    Second the opportunities to make money have perhaps lured some people away
    from research per se. I don’t really know the extent to which this is true.
    Maybe they were tired of research.
  </p>

  <p>
    Third much of the theoretical work in AI is beside the point and unlikely to
    lead to advances toward human level intelligence. The mathematically
    talented like well-defined conjectures the wherein the mere statement of the
    result that has been proved or the asymptotic behavior of the algorithm
    discovered wins instant scientific recognition. AI badly needs mathematical
    and logical theory, but the theory required involves conceptual innovations
    - not just mathematics. We won’t reach human level intelligence by more
    algorithms reducing the complexity of a problem from n to n log n and still
    less by proofs that yet another problem is unsolvable or NP-complete. Of
    course, these results are often very significant as mathematics or computer
    science.
  </p>

  <p>
    Fourth, like many fields AI is given to misguided enthusiasms in which large
    numbers of people make the same errors. For example, much of the present
    work in natural language processing seems misguided to me. There is too much
    emphasis on syntax and not enough on the semantics. Natural language front
    ends on programs that convert between existing AI formalisms and English
    miss the point. What we can learn from natural language is not how to
    express in English what we already know how to express in computerese.
    Rather we must study those ideas expressible in natural language that no-one
    knows how to represent at all in a computer.
  </p>

    course, these systems of limited intelligence may have substantial practical

    goals of AI and should think how to apply their own talents in the best way.
    If they can do first class basic research they should.

    2. In my opinion, the key problem at present is the formalization of common
    sense knowledge and reasoning ability. It still looks to me that separating
    epistemology from heuristics will pay off.
  </p>

  <p>
    3. We need to think hard about how to make experiments that are really
    informative. At present the failures are more important than the successes,
    because they often tell us that the intellectual mechanisms we imagined
    would intelligently solve certain problems are inadequate.
  </p>

  <p>
    4. We need good problem domains — the AI analog of what the Drosophila did
    for genetics. The Soviet computer scientist A. S. Kronrod once referred to
    chess as the Drosophila of artificial intelligence, because it permitted
    comparison of human and artificial intellectual mechanisms. Unfortunately,
    chess was discouraged as a serious problem domain, and most chess
    programming is carried on at the level of sport rather than science. In
    particular, there is little publication about the intellectual mechanisms
    involved, and the race often involves merely faster hardware.
  </p>

  <p>
    5. I also believe there is a large payoff in a more general analysis of the
    concept of pattern. Finally, let me cheerfully admit that general harangues
    like this one are no substitute for scientific papers setting forth specific
    problems in detail. I hope that other members of AAAI will express their own
    opinions about what the basic research problems are.

Once there was a redheaded man without eyes and without ears. He had no hair either, so that he was a redhead was just something they said.
He could not speak, for he had no mouth. He had no nose either.
He didn't even have arms or legs. He had no stomach either, and he had no back, and he had no spine, and no intestines of any kind. He didn't have anything at all. So it is hard to understand whom we are really talking about.
So it is probably best not to talk about him anymore.
